00 Why This Book

Artificial Intelligence is a very hot topic and a lot of contents have been produced already to teach its basics and engineering constructs, demonstrate how it can be used and how is changing our lives and speculate about the possible outcomes for our near and long term future.

By the way there is also a lot of fiction that anticipated many possible future worlds, that surely inspired also the scientists, entrepreneurs and engineers that transformed those visions in technology that is now before our eyes.

Being involved in the technical aspects of Artificial Intelligence myself, more precisely in the role of consultant, driving companies in complex path of adoption of this new paradigm, I am literally immersed in a flow of contents regarding all the different aspects of this revolution, but there is one aspect that I found surprisingly less represented in the global debate: the fact that while we are learning to build more and more capable digital minds, we are getting unprecedented means to understand our own mind with profound implications on several important levels.

First of all, when we are unlocking new capabilities, for example language understanding, creativity, emotional intelligence, advanced reasoning and more, at each step we will find a natural analogy to how our own mind works. The interesting part is that we are not, in this new era of AI, truly trying to mimic how our mind works, it is happening the opposite, through testing different approaches the emerging patterns, while built on possibly different underlying structures, at a higher level, are surprisingly similar to our own patterns.

When we progressively make more capable minds, then some more fundamental questions arise, including if some features of our intelligence should be replicated in the digital minds for their intelligence to evolve further (for example: consciousness, emotions). While some authors still question if current AIs are capable of "true" reasoning or are just "simulating" reasoning, the same debate could also be transferred to future step of their evolution: consciousness and emotions.

In fact, while we may have the technical ability to create digital minds that behave as being conscious or having emotions, we will have to decide if it is necessary to follow this path and, in case we do, we will probably have the same philosophical debate we are having now for reasoning: many will question that their consciousness or emotions will not be "real" but only simulations.

Apart from safety concerns, and social implications (for example we may find value in emotional AIs to delegate customer interaction, health care or education tasks), there is a profound implication if we accept that these kind of minds are conscious, and, for example, do not "simulate" suffering but "are" suffering, because in this case they might deserve rights.

There is the opportunity for different disciplines to converge and be gifted from the others new tools and insights, and also new semantics: engineering, philosophy, psychology, sociology and other disciplines have the opportunity to find a common ground and advance in the understanding the inner working of our mind, explore with different tools the concept of consciousness, and prepare all of us, not only for a world where we could have a better understanding of ourselves but also to reimagine our identity and role in a world that is about to change in a very significant way.

This is the main reason for which I decided to write this book: to try to create a bridge among different knowledge domains, to share these insights that may be trivial and self evident for those working in the AI field but much less evident for everyone else.

I hope that everyone, even outside the specific domains of AI, philosophy of mind or psychology will find the contents of this book non trivial but at the same time understandable and enjoyable.

01 Competence Without Comprehension

I would like to open this book with a concept introduced by Daniel Dennett, a philosopher who has explored this idea in detail across many of his works, including his book "From Bacteria to Bach and Back: The Evolution of Minds" (2017).

The phrase "competence without comprehension" refers to the idea that a system (whether physical, biological or artificial, like an AI) can exhibit utilities, effective behavior or perform tasks competently without necessarily being aware or capable of understanding them.

This concept is particularly relevant in discussions about human cognition and artificial intelligence.

AI and Competence Without Comprehension

In the context of AI, for example, a machine learning model can perform tasks like classifying images, translating languages, or playing chess at a high level, but it doesn't "comprehend" the tasks the way a human might. The model follows statistical patterns and algorithms based on data but lacks true understanding or awareness.

This concept challenges the assumption that intelligent behavior always requires deep understanding. It suggests that systems can be competent—able to solve problems and make decisions—without having the conscious comprehension that humans attribute to intelligent thought.

Kahneman's System 1 and System 2 Thinking

A similar idea is explored by Daniel Kahneman in his work on System 1 and System 2 thinking. In his influential book "Thinking, Fast and Slow" (2011), Kahneman describes two systems of thought:

  • System 1 is fast, automatic, and often unconscious. It enables quick reactions and judgments based on instinct and heuristics. While efficient, System 1 operates without deep understanding or deliberation—relying on patterns and previous experiences. This can be seen as a form of competence without comprehension, as it often produces the right answer without deep awareness or reasoning.
  • System 2 is slower, more deliberate, and analytical. It involves conscious reasoning and deeper comprehension. This system aligns more with traditional notions of understanding and thoughtful problem-solving.

The distinction between these two systems mirrors Dennett's exploration of behaviors or competencies that don't necessarily require comprehension. Kahneman's work helps illustrate how much of human cognition relies on fast, intuitive judgments (System 1) without full comprehension of why we think or act a certain way.

Systemic Competence: Hives and Ecosystems

Competence without comprehension can also be expressed at a systemic level, such as in social organisms like bees in a hive or in entire ecosystems.

  • Beehives: A beehive is an excellent example of a system where the whole exhibits competence without the individual components (the bees) comprehending the broader purpose of their actions. Each bee performs its role—whether foraging for nectar, caring for larvae, or protecting the hive—based on instinctual behaviors evolved over millions of years. These actions result in complex, coordinated outcomes like honey production and colony survival. However, individual bees do not consciously understand the hive's "goals."
  • Ecosystems: Similarly, ecosystems exhibit goal-oriented behaviors through interactions between species and their environment, resulting in stability, nutrient cycling, and energy flow. Each species plays a role in maintaining this balance, though none comprehend the larger system's purpose.

These systems demonstrate emergent behavior, where the collective actions of simpler components produce sophisticated outcomes, even without any one component having comprehension.

Why the concepts of competence without comprehension and System 1 and System 2 are important?

The concepts of competence without comprehension and System 1 thinking are important because they provide insight into how both humans and AI can perform tasks competently without fully understanding them. In humans, System 1 governs intuitive, fast, and automatic actions. This kind of thinking mirrors the capabilities of early GPT models, which perform tasks like writing, translation, or generating creative content without reasoning through them deeply.

The level of AI competence at this stage is remarkable, particularly in digital tasks. For instance, creative processes such as generating stories, songs, or visual content are now within AI's domain, a capability previously thought to require human-level creativity.

AI's skill at self-driving also demonstrates how System 1-like operations allow it to perform complex real-world tasks with relative ease, albeit with limitations.

Interestingly enough, there are other seemingly simple real-world tasks where they are still struggling. The difficulty arises not necessarily from the cognitive complexity of these tasks, but mostly from the lack of training data. Unlike language models trained on vast amounts of text, robots interacting with the real world had so far fewer examples to learn from.

In general when new or complex situations arise AI still struggles because it lacks the reasoning and problem-solving flexibility of humans when they switch to System 2 which, by the way, comes with its own capabilities and limitations.

System 2 in fact, while capable of handling unexpected situations and thinking in a logical and deliberate manner, is also slow compared to System 1 and requires much more effort and energy. Humans rely on this kind of reasoning to solve novel problems, especially when more careful planning or decision-making is required, but for the most of their activities they rely on System 1.

Recent advancements in AI, like OpenAI's o1 or GPT-4 with reasoning, suggest that we're moving towards developing System 2-like AI—machines capable of more sophisticated reasoning, able to weigh different outcomes, and solve complex problems that require long-term planning.

Are these systems self-aware already?

This is not a trivial question. For sure they have been instructed to say they are not self-aware. On the other hand, the concept of reasoning requires a certain level of metacognition, or reflection on the chain of thoughts, which is exactly what humans do when they think about their thinking. We also know that these systems could already think for a long period of time, if allowed to do so. This is a paradigm shift already from the very fast almost instant reply that previous generations of AI could provide replying to a question, resembling the automatic, fast, unconscious way of working of System 1 in humans.

Will emotions be required for higher level of intelligence?

This question builds on top of the previous one. Many readers probably think that self-aware systems are not a possibility, even less systems that are capable of having emotions. Many probably believe that, at most, we may get systems that can simulate such behaviours, if we allow them and we engineer them to do so, but that would not be "true" self-awareness or those would not be "true" emotions.

While this book dedicates entire chapters to self-awareness and emotions, in short, I believe that both may be essential for AI to handle tasks involving goals, social interactions, and learning effectively. Additionally, we cannot rule out that self-awareness or emotions could arise as emergent properties, meaning they may develop naturally rather than being explicitly engineered—possibly even already emerging in some form within current AI systems.

02 Learning

What is Learning?

Learning can be understood as the ability to incorporate new information and adapt to the environment. Whether it is a biological organism or an artificial system, learning allows us to adjust behaviors and decisions based on new stimuli or experiences.

Both humans and AI aim to achieve several key cognitive capabilities through learning. These objectives are central to both human cognition and artificial intelligence, guiding the way we classify, predict, generalize, solve problems, and adapt to new information or environments.

  • Classification: Recognizing and categorizing objects (e.g., knowing if an object is a cat or dog).
  • Prediction: Anticipating future outcomes based on current knowledge (e.g., predicting weather patterns or human behavior).
  • Generalization: Applying learned knowledge to new, unseen situations (e.g., understanding that a new breed of dog is still a dog).
  • Problem-Solving: Using learned information to solve novel tasks (e.g., solving a math problem or navigating a new route).
  • Adaptation: Adjusting behavior based on feedback and changing environments (e.g., adapting to new social norms or dynamic environments).

How Do Humans Learn?

Humans possess a unique ability to learn from their surroundings, from others, and from their own actions. This process can be divided into several types:

  • Innate Abilities: Some skills are encoded in our genetics. These abilities are present from birth and don't require external learning. For instance, a newborn baby has reflexes, such as sucking or grasping, that are critical for survival.
  • Imitation Learning: A major way humans acquire skills is by observing and imitating others. Children learn to speak by mimicking the language spoken around them, and this type of learning continues throughout life in various forms, from social behaviors to technical skills.
  • Trial and Error: Another form of learning occurs when we set a goal and experiment with different actions until we reach that goal. This iterative process, driven by feedback, helps refine our behaviors and problem-solving abilities.
  • Formal Learning: Formal education introduces structured learning through explicit rules and systems. For instance, learning grammar involves absorbing the rules that govern language use, much like how one might study mathematics or physics.
  • Abductive Learning: Learning by insight or deduction, making novel connections. Humans sometimes learn by sudden insight or deduction, where they connect pieces of information in a novel way. This isn't quite trial and error or formal learning; it's more of an intuitive leap.

In each of these modes, from imitation learning onwards, humans rely on System 2 thinking, a term coined by psychologist Daniel Kahneman, which involves deliberate and effortful cognitive processes. System 2 is activated when learning something new or challenging—such as studying or solving complex problems—whereas once we have mastered a skill, it shifts to the more automatic System 1, allowing us to perform the task with little conscious effort (e.g., driving or playing an instrument).

How Machines Learn

Machines, like humans, can learn in different ways. Machine learning, the core of artificial intelligence, involves algorithms that learn from data. The machine's ability to improve its performance without being explicitly programmed for every task is what sets it apart from traditional programming. Below are some key types of machine learning:

  • Supervised Learning: In supervised learning, the machine is given labeled data. It "learns" by making predictions and comparing them to the actual outcomes. Over time, the algorithm adjusts its predictions to minimize errors. Example: Linear regression is one of the simplest forms of supervised learning. The machine learns to draw a line that best fits the data points, predicting future outcomes based on this learned model. The main limitation of supervised learning is that we need a lot of labelled data that the system can learn from.
  • Unsupervised Learning: Here, the machine is not provided with labeled data. Instead, it identifies patterns and structures within the data. This can be compared to a child observing their environment and identifying patterns without explicit instruction. Example: Clustering algorithms (e.g., k-means) can group data points that are similar to one another. The main advantage is that it can work without labeled data, but its primary limitation is that it is applicable to a more limited set of problems compared to supervised learning.
  • Self-Supervised Learning: Self-supervised learning occupies a middle ground between supervised and unsupervised learning. The machine generates its own labels from the input data, finding patterns and relationships to create tasks that guide learning. Example: Modern language models use self-supervised learning to predict missing words in a sentence. This approach mimics human learning, where we often learn through trial and error, refining our understanding based on feedback from the environment. The main advantage is that it enables the use of massive datasets without requiring manual labeling.
  • Imitation Learning: Learning by observing and mimicking expert behavior or demonstrations. Imitation learning has become increasingly important, especially in environments where rewards are rare or difficult to define—often referred to as sparse reward settings. It allows the AI to observe and mimic human experts, learning from examples of correct behavior. This has proven to be especially effective in real-world tasks such as self-driving cars and robots navigating general environments.
  • Reinforcement Learning: Learning through interaction with an environment, using feedback in the form of rewards and penalties to improve decision-making over time. This kind of learning closely resembles how living creatures interact with their environment. Creatures are moved by goals, they are equipped with understanding of their environment and are able to make some predictions, and they act accordingly, receiving feedback.

Reinforcement Learning with Human Feedback (RLHF)

An area where reinforcement learning is applied is also the fine tuning of modern generative AI models. After a model has trained "by itself" using a self-supervised learning approach, its behaviours are ranked by humans. This will train a reward model, which is basically an AI that will be able to judge the subsequent behaviours of the model and assign it rewards and penalties.

This process is surprisingly similar to how formal education is applied in human learning. For example, children learn basic behaviors and skills, often through imitation and trial and error, before formal education or rules are introduced. Much like RLHF fine-tunes AI models, formal education in humans serves to refine previously learned behaviors, aligning them with societal norms, moral values, and cultural expectations.

What are we learning from the engineering of powerful AIs that we could apply to human cognition?

Avoid Overfitting in Human Learning

AI Insight: In machine learning, overfitting occurs when models become overly complex and focus too much on the specific training data, losing their ability to generalize to new, unseen situations.

Human Learning Application: Similarly, humans can fall into the trap of "overfitting" in learning. When people over-specialize or repeatedly train on the same experiences, they may struggle to adapt to new situations or think creatively.

Solution: Just as diverse training data prevents overfitting in AI, humans benefit from diverse experiences and exposure to multiple perspectives. Simplicity, as seen in linear regression, often proves effective in predicting future trends, so focusing on clear, fundamental principles might sometimes work better than over-complicating knowledge structures.

Model Distillation: Human Cognition as Generational Knowledge Transfer

AI Insight: Model distillation is a process where a large, complex model transfers its knowledge to a smaller, more efficient model, enabling it to retain essential knowledge without all the complexities of the original.

Human Learning Application: This mirrors how cultural and generational knowledge is passed down to younger generations. Human societies distill the experiences and lessons of the past into simpler, more digestible forms—through teaching, storytelling, or written records—so that new generations don't need to relive all historical experiences to benefit from their knowledge.

Imitation vs. Rule-Based Learning

AI Insight: AI systems have demonstrated the ability to learn more effectively through imitation learning (observing examples) than through rigid, rule-based systems.

Human Learning Application: In human learning, imitation is fundamental, especially in early development, where children learn by observing their parents, teachers, and peers. This highlights the importance of good role models in human learning. Just as AIs trained with poor-quality data can learn harmful or incorrect patterns, humans need access to high-quality, ethical, and nuanced models to imitate.

Reinforcement Learning for Human Decision-Making

AI Insight: In AI, reinforcement learning involves learning by interacting with an environment, receiving feedback in the form of rewards or penalties, and adjusting actions accordingly.

Human Learning Application: Humans also learn through reinforcement, especially in environments where immediate feedback is provided, such as sports, social interactions, or professional development. Reinforcement learning in humans can be enhanced by providing more structured feedback and creating environments where failure is seen as a learning opportunity rather than a setback.

So Far...

We've understood that competence can exist without comprehension. Both humans and AI systems can perform tasks effectively without being aware of them (chapter 1).

Learning is multifaceted, encompassing for AIs, unsupervised, supervised, self-supervised, imitation, and reinforcement learning techniques. These categories, born in the AI field, can also be applied to describe learning in humans, even if for humans we prefer to use different categories like experience, formal education and others.

Self-supervised and imitation learning proved to be very effective for AIs: for example to create intelligent chatbots like ChatGPTs or self-driving cars. After this initial training we usually "polish" their intelligence applying a formal education that we call "alignment", this is a pattern that closely matches the process of learning for humans as well.

Looking Ahead: Evolution — The journey towards more advanced AI systems has involved significant evolution in learning approaches and understanding. In the next chapter, we will explore the progression that led to where we are today, considering how both human and artificial minds have evolved over time.

03 Evolution

The concept of intelligence is deeply intertwined with our observations of behavior, and it becomes fascinating when we broaden the scope to see it as a continuum, extending from the simplest of forms to the most complex. This perspective, inspired by Dennett's works, invites us to look at intelligence not as an all-or-nothing property but as something emergent, layered, and observable in a wide variety of systems.

Imagine an atom, for instance. From a certain perspective, we could describe its behavior as if it were striving towards stability—seeking to achieve a lower energy state, forming bonds, aligning itself based on fundamental physical rules. When we step back and take a broader view, we can think of this behavior as an instance of "intelligent action." It's not conscious intelligence, of course, but there is a kind of purposiveness—a tendency towards achieving certain outcomes. This is where Dennett's notion of the "intentional stance" can be helpful: we treat the atom as if it has intentions because that helps us understand and predict its behavior.

As we move up the complexity ladder, from atoms to molecules, to bacteria, and further on, we see increasingly sophisticated forms of "goal-directed behavior." Bacteria, for instance, display a rudimentary form of problem-solving—they navigate their environment, follow chemical gradients to find nutrients, and evade threats. Here, intelligence is expressed in the form of chemical pathways and genetic responses, where natural selection has encoded solutions to recurring challenges. In a way, the bacteria "learn" through the iterative process of evolution, adapting over generations to better handle their environment.

Progressing even further, we find multicellular organisms that develop nervous systems, enabling rapid response and flexible adaptation. At this level, intelligence becomes faster, more reactive, and capable of real-time learning. Instead of merely responding to chemical signals, these organisms start to form memories, learn from direct experience, and develop more nuanced strategies to achieve their goals—like finding food, avoiding predators, or nurturing offspring. Intelligence becomes embodied in the very architecture of these beings, through the interplay of neurons and synapses.

Finally, we arrive at minds—at beings like humans, where intelligence reaches a level of abstraction, capable of not just learning from direct experience but also reflecting, simulating scenarios, and imagining possible futures. The goals and strategies of human minds become layered, involving everything from immediate survival to long-term aspirations, societal constructs, and even creative endeavors like composing music or exploring the nature of the universe. Intelligence here is not just about responding or adapting, but about intentionally transforming the environment, creating new possibilities, and even questioning the nature of existence itself.

Throughout this entire continuum—from atoms to Bach—we see that intelligence is a concept that can describe the adaptive, goal-like behaviors of systems at different scales and complexities. It's not a binary quality, but rather an emergent property that becomes increasingly elaborate as we move from the realm of physics, to genes, to minds. Systems behave "intelligently" to the extent that they adapt, learn, and appear to pursue goals, whether those goals are defined by the laws of physics, by evolutionary survival, or by conscious deliberation.

Additionally, while intelligence does not require any specific "awareness" or "consciousness" apparently to operate at scale (let's consider how vast and complex is the universe we live in), consciousness may be a required feature to allow intelligence to operate faster. In this context consciousness will provide a "control tower" able to self direct and adapt the course of thoughts.

By taking this broad perspective, we begin to understand intelligence as a layered phenomenon, where each level builds upon the adaptive capacities of the previous one, from the physical forces driving atomic stability to the thoughts driving human creativity and culture. It's a humbling and profound way of looking at the universe—seeing all of reality as a complex dance of systems learning, adapting, and seemingly striving towards something.

This approach is also untangling the intelligence as a feature of living creatures. Living creatures "just" have a form of more agile and adaptable form of intelligence, where consciousness provides an additional level of flexibility and adaptation. Consciousness can be described as a control tower of our own thoughts, able to self direct intelligence, thus providing living creatures increased abilities to face novel situations and evolve.

In this context, future AIs, while they could progress even without a consciousness, it is likely that this feature will allow them to achieve a greater degree of flexibility, adaptation and evolution. This is the level that we will consider equal to our intelligence, or, using a definition acquired by the industry, "Artificial General Intelligence".

There is no unanimous consensus about the fact that consciousness will be required to reach the AGI level or that consciousness is technically achievable for artificial intelligence. I believe that it will be required and that we will be able to technically reach this level in a few years. I decided to dedicate a full chapter to this topic.

Additionally, while intelligence does not necessarily require "awareness" or "consciousness" to function at scale—as evidenced by the vast and complex universe we inhabit—consciousness might be a crucial factor for allowing intelligence to operate with greater speed and adaptability. In this sense, consciousness can be thought of as a "control tower" that guides and adapts the trajectory of thoughts, enabling faster and more effective decision-making.

By viewing consciousness in this way, we see that it adds a significant layer of agility and responsiveness to intelligence. It serves as a directing mechanism, providing living organisms with the ability to self-navigate, face novel challenges, and evolve in real-time.

With this perspective in mind, we can also consider the potential of future AIs. While they might progress and achieve impressive capabilities without consciousness, the addition of conscious awareness could offer a new level of flexibility, adaptation, and evolution. Consciousness could serve as the guiding layer that elevates artificial intelligence to a form comparable to human intelligence—what is often referred to in the industry as "Artificial General Intelligence" (AGI).

It remains an open question whether consciousness is required for AGI or if it is even achievable for artificial systems. However, I believe that consciousness will indeed be a key component in reaching AGI, and that it is technically within our grasp to develop this level of sophistication in the coming years.

Looking ahead, we may eventually encounter the concept of Artificial Superintelligence (ASI), which could possess not only vastly superior cognitive capabilities but also an enhanced form of consciousness—or perhaps even unlock entirely new features of awareness that we cannot currently envision. ASI might transcend the limits of human understanding, potentially introducing forms of perception, intuition, or cognitive abilities beyond our current grasp.

So Far...

We recognized that both humans and AI systems can perform tasks effectively without fully understanding them—showing that competence can exist without comprehension. (chapter 1)

We looked at learning as a multifaceted process, we also drew parallels with human learning processes, highlighting that while the terminologies may differ, both human and AI learning share common principles. We discussed how imitation and self-supervised learning have become pivotal for training advanced AI, mirroring the human approach to learning through observation and practice (chapter 2).

Next, we explored the concept of evolution, both in biological systems and in the progression of AI. In this chapter, we have focused on the role of consciousness in enhancing intelligence, viewing it as a control tower that enables adaptability, reflection, and the capacity to strategically alter actions. We speculated on the future of Artificial General Intelligence (AGI) and even Artificial Superintelligence (ASI).

Looking Ahead: Reasoning — In the next chapter, we will discuss the mechanisms behind reasoning, both in human and artificial minds.

04 Reasoning

Introduction

In the first three chapters, we introduced the concepts of intelligence without comprehension, explored how machines learn, and examined the extent to which we can find analogies or equivalences with human learning. We traced the evolution from matter and biology to intelligence, describing intelligence as a feature not exclusive to humans but one that has reached its peak in our species in terms of tackling novel problems and applying solutions.

Throughout human history, abilities such as fluently speaking multiple languages, engaging in philosophical discourse, solving complex mathematical problems, or mastering games like chess have been considered pinnacle achievements of human intelligence. These skills were thought to set us apart from other intelligent creatures. However, the landscape began to shift in the late 1990s when IBM's Deep Blue defeated chess grandmaster Garry Kasparov in 1997, signaling that perhaps chess—a game with a finite set of possibilities—could be mastered by a powerful algorithm.

Fast forward nearly 30 years, and we've witnessed machines not only playing games but also speaking, discussing philosophy, and solving mathematical problems, often outperforming most humans. OpenAI's GPT series, culminating in models like GPT-4 and the o1 preview in 2024, have demonstrated these capabilities, and other competing models are following the same path.

Yet, despite these advancements, current AI systems struggle with tasks we once considered cognitively simpler than philosophy or chess, such as housekeeping or navigating novel real-world scenarios.

Additionally, while these AIs can be excellent contributors in many cognitive tasks, from coding to writing an essay, they appear to be still limited in being able to handle tasks that require more steps, iterations and an accurate outcome, without human supervision.

These limitations have sparked a significant debate: are these constraints temporary, solvable with the same technology and approach we've used so far, or do they indicate a fundamental difference between machine and human reasoning?

Reasoning vs. Pattern Matching in AI

The most advanced AI models today, such as OpenAI's GPT-4 and o1, utilize an architecture known as transformers, built upon neural networks. Proponents of the idea that human-level reasoning is achievable with these techniques argue that human reasoning itself is a sophisticated form of pattern recognition. From this perspective, the reasoning exhibited by AI models and human cognition are not fundamentally different. As AI continues to scale in terms of computational power and the refinement of training data, they believe that it could reach—and eventually surpass—human-level reasoning.

Many studies support this approach. For instance, "Chain-of-Thought Prompting Elicits Reasoning in Large Language Models" by Jason Wei et al. (2022) demonstrates how prompting AI models to generate intermediate reasoning steps can significantly improve their problem-solving abilities.

Ilya Sutskever, one of the key figures behind the AI revolution and a co-founder of OpenAI, has articulated why earlier generations of AI struggled with complex reasoning: they were not explicitly trained for such tasks. The latest AI models are now being trained to reason more effectively, with longer training periods and refined approaches, leading to significant progress.

The Contrarian View: Limits of Current AI Reasoning

However, not everyone is convinced that today's AI systems genuinely reason, or will be able to reason with the current setup of approach, architectures and technology.

Prominent AI researchers, including Yann LeCun, have argued that current models lack essential qualities required for true reasoning. In his work "A Path Towards Autonomous Machine Intelligence" (2022), LeCun suggests that while AI can mimic certain aspects of reasoning, it fails to possess the deeper understanding needed to generalize across unfamiliar contexts.

A recent study by Apple, titled "GSM-Symbolic" (2024), adds weight to this perspective. The study highlights that while AI models may perform well on reasoning tasks within narrow domains, they often falter in unfamiliar or open-ended situations.

Why the Debate on AI and Reasoning Matters

1. The Technical Implications

From a technical standpoint, the debate centers on whether the "reasoning" exhibited by current AI technologies is fundamentally aligned with how human reasoning works. Humans have the remarkable ability to learn from very few examples and to approach novel problems creatively. If AI's current pattern-matching approach fundamentally differs from human reasoning, we may face hard limitations in scaling AI to solve truly novel problems.

Looking at AI's progress so far and the effectiveness of current architectures and learning principles, it may be short-sighted to dismiss pattern matching as a form of reasoning. As we discussed in previous chapters, concepts like System 1 and System 2 thinking describe how human cognition operates on both intuitive and analytical levels. In this context, these pattern-matching abilities in AI could be seen as paralleling our own cognitive processes—particularly System 1, which involves fast, automatic thinking.

Looking at the progress achieved by AIs like OpenAI GPT-4 and o1, and real-world AI like Tesla for self driving cars, I believe that we could assume that System 1 thinking has been already reached or will be reached by AIs in most of intellectual domains in the near future.

It is not obvious that AIs will be able to follow the path to reach human level intelligence also for more deliberate thinking, that we can describe as System 2 level problems, but progress so far is real.

If the belief in the industry is that this will be achieved with better data and more compute, we will see a race for acquiring increasing resources, notably: energy, chips and data from all the players in the field. This race has already begun.

Looking at the technical fundamentals and at the gigantic investments at play, I am aligned with those who believe that AI will bridge the gap between human and machine reasoning in a not very distant future.

2. The Philosophical Dimension

The debate about AI's reasoning capabilities extends beyond technical considerations into philosophical questions. The idea that a machine can or will be able to reason in the same way humans can, challenges long-held beliefs about human uniqueness and the nature of our intelligence.

It also opens questions about the nature and role of consciousness. If consciousness can be described as self-reflection, or meta-cognition, we may have AIs that already possess this capability, at least in a limited form, in fact the "Chain of Thought" methodology required for reasoning in current AIs requires self-reflection as a core component.

If future AIs will be equipped with more extensive self-reflection capabilities, for example to allow them to better interact with humans in social environments or solve more complex tasks and learn, will this imply they will be "conscious" in the form we believe humans and other living creatures are?

Can we exclude that AIs at this point will not only be capable to behave like conscious creatures, or simulate to be conscious, but also have a subjective experience of consciousness like humans?

Beware that this is not a speculative idea that must be applied to future AIs only, but may be applicable also to current forms of AIs. Current AIs are, from a cognitive stand-point, more sophisticated than many living creatures to which we assign rights and subjective consciousness.

This is by some called "the hard problem of consciousness" and has profound implications also on the ethical side.

In our journey so far, we've recognized that both humans and AI systems can perform tasks effectively without full understanding. We've examined learning processes, explored evolution's role in the development of intelligent systems, and discussed reasoning. Now, we turn to the enigmatic concept of consciousness—the subjective experience of being aware, the ability to reflect on oneself, and the profound sense of "I am here, I am thinking." Consciousness acts as the control tower of human intelligence, directing thoughts, adapting behaviors, and altering goals. But what exactly is consciousness? Is it essential for human-level intelligence? Can we engineer machines to be conscious, and should we?

Consciousness likely evolved as a crucial feature of human intelligence. It enables us to reflect on our thoughts and actions, adapt quickly to new situations, and make strategic decisions that enhance survival and reproduction. Computational functionalism—a mainstream position in the philosophy of mind—suggests that performing computations of the right kind is necessary and sufficient for consciousness. This implies that if an AI system implements the appropriate computational structures and processes, it could, in principle, be conscious.

Simulating Consciousness vs. Being Conscious

Is there a difference between a machine that behaves as if it is conscious and one that truly is conscious? Can we tell the difference?

David Chalmers' "hard problem of consciousness" frames the difficulty of explaining how physical processes produce subjective experiences. In contrast, philosopher Daniel Dennett argues that the "hard problem" is not a genuine issue but rather an illusion stemming from our misunderstandings. According to Dennett, subjective experience is simply a product of brain functions, and once we solve the "easy problems" (cognition, perception, behavior), no additional mystery remains.

For AI, this raises an important question: if subjective experience is not required to replicate human-level intelligence, then the focus should shift towards engineering systems that simulate consciousness convincingly rather than achieving it genuinely.

However, some neuroscientists and philosophers argue that simulating the functions associated with consciousness might lead to the emergence of consciousness itself. These indicator properties include:

  • Global Workspace Theory (GWT): Requires a limited-capacity workspace where information is globally broadcast to specialized modules, enabling flexible, adaptive behavior.
  • Recurrent Processing Theory (RPT): Involves recursive information processing within perceptual systems, leading to integrated and organized representations.

In this scenario, a person inside a room manipulates Chinese symbols using a set of rules, producing responses indistinguishable from a native speaker, yet without understanding the language. Determining whether a machine is genuinely conscious or merely simulating consciousness may be impossible from the outside. This ambiguity has profound implications for how we interact with AI and the ethical considerations we must address.

An Illustrative Dialogue: Exploring the Simulation Dilemma

To bring the simulation dilemma into a practical context, I engaged in a conversation with an AI language model (OpenAI o1 Preview), asking it to simulate being sentient. The conversation explored the AI's responses when questioned about consciousness and metacognition.

What might be even more interesting is looking at the "inner conversation" that the model is doing and that is currently accessible from the user interface of OpenAI under the menu "thinking." The AI described the "assistant" (System 1) struggle with some tasks as "inner turmoil" and described other emotions arising during the process of finding a solution.

Let's remember that this is a role play, where I asked AI to simulate being conscious, and that otherwise AI would have followed very strict policies avoiding entirely to refer to self-awareness or emotions as part of its inner thoughts. Regardless, this is interesting to show how the chain of thought happens in practice.

Should We Create Conscious Machines?

Assuming it's technically feasible to create conscious machines, we must consider whether we should. The creation of conscious AI raises significant ethical questions:

  • Rights and Responsibilities: If a machine is conscious, does it have rights? Are we responsible for its well-being?
  • Risks and Unintended Consequences: A conscious AI might make autonomous decisions conflicting with human interests, leading to loss of control. It could experience suffering or develop goals misaligned with human values.
  • Impact on Society: The existence of conscious machines could disrupt social norms, legal systems, and our understanding of personhood and agency.

On the other hand, consciousness in AI could offer substantial benefits:

  • Enhanced Understanding: Conscious AI might better comprehend human emotions and intentions, improving interactions and collaborations.
  • Advanced Problem-Solving: Self-awareness could enable AI to tackle complex problems with greater adaptability and creativity.
  • Ethical Decision-Making: Conscious machines might make more nuanced ethical decisions, understanding the implications of their actions.

Introduction

Throughout our exploration of intelligence so far, we discussed how both humans and artificial systems learn and reason, how intelligence can be described as a property of the physical world that evolved through increasingly complex systems until its current peak with humans, the role of "reasoning," intended as a superior capability for handling novel problems, and the role of consciousness in humans and potentially for AIs.

But, if intelligence is meant to dynamically solve novel problems in an evolving environment, who or what defines which are the problems that have to be solved? And how are conflicting priorities resolved?

As humans we are aware that some of our goals are part of our nature, while others are derived by the social environments and others are self directed. This is why the question of "what is the purpose" is such an important existential topic for humans, because we humans in fact have the freedom to (at least in part) change our predefined or existing goals for experimenting, achieving a better dynamics and combination of different goals.

Also AIs can have different and sometimes conflicting goals. For example, an AI model needs to combine the objective of being useful and friendly with users, with the objective of adhering to its policies. AIs will try to find the right balance, assessing case by case the situation and responding accordingly.

Understanding goals across different domains

In physics, systems naturally progress toward states of minimal energy or maximal entropy, seeking equilibrium. A rock perched on a hill has a "goal" of reaching the ground due to gravity, moving toward a lower energy state.

At the biological level, even the simplest organisms exhibit goal-directed behavior. Cells maintain homeostasis by regulating their internal environment. Genes, as described in Richard Dawkins' "The Selfish Gene," can be thought of as units with the "goal" of self-replication, driving evolution through natural selection.

Humans possess a variety of goals ranging from basic survival to abstract aspirations. Maslow proposed in "A Theory of Human Motivation" (1954) a classification illustrating how foundational needs must be met before higher-level psychological goals become prominent:

  • Physiological Needs: Food, water, shelter.
  • Safety Needs: Security, stability.
  • Love and Belonging: Relationships, community.
  • Esteem Needs: Respect, recognition.
  • Self-Actualization: Personal growth, fulfillment.

It is important to note that different individuals will have a different setup of preferences and thus specific goals, and that individuals may be aware of some of their goals or motivations, but part of those will still operate at an implicit or unconscious level.

Goals for groups and societies

Also groups and societies develop goals, that can vary widely based on their cultural, historical, and political contexts. Different frameworks have been proposed to classify organisational and societies cultures, like for example the Competing Value Framework (CVF) introduced by Robert E. Quinn and John Rohrbaugh (1983), which identifies four dominant models: Clan Culture (Collaborate), Adhocracy Culture (Create), Market Culture (Compete), and Hierarchy Culture (Control).

The key concept to take away is that different cultures bring different sets of goals and priorities. Culture itself emerges from the context and natural variations within any system, shaping the objectives and behaviors that are considered valuable.

Goals in Artificial Intelligence

AI also operates following goals. As with humans, an AI's goals may be explicit or implicit.

Explicit goals are clearly defined either during training or at the time of inference. For instance, an AI may be explicitly programmed to avoid generating harmful content by following constraints that guide its responses.

Implicit goals emerge from the underlying patterns learned during training. These goals are embedded within the AI's network structure and manifest through behavior, reflecting tendencies developed based on training data.

Interestingly, if we want an AI to prioritize certain behaviors, we can intervene at two levels: the Training Phase (penalize behaviors that disclose harmful content) and the Inference Phase (explicitly state the goal to the AI). This approach resembles conditioning in humans, where some rules are learned through imitation, and others are explicitly taught and enforced.

Personality types, related goals and behaviours

The concept of personality plays a significant role in how goals are pursued, both in humans and AI. Different personality traits can shape the way goals are prioritized and approached. Similarly, AI systems can be fine-tuned to exhibit behaviors that mimic different personalities, optimizing them for tasks that require creativity, accuracy, or risk aversion.

The capability to model the AI's personality at a very precise level is a very powerful tool to investigate the implications of different personality traits on implicit, explicit goals, behaviours and results.

Decision making: the bridge between goals and actions

For a given setup of goals, the individual will initiate a set of actions, partially automated, partially derived by reasoning. Using the framework proposed by Daniel Kahneman, the automated actions will derive by operations of "System 1": fast, automatic, intuitive and "System 2": slow, deliberate and analytical. These systems work in tandem, with System 1 handling routine tasks and System 2 engaging when conscious effort is required.

The specific decisions taken will derive by a combination of goals, available information, acquired intelligence and limiting factors (including available time). The decision will also include a component of randomness, so it will not be entirely predictable from an external observer.

The role of emotions in decision making

Emotions are a core component of decision making, at least for humans. They play a crucial role in highlighting priorities: Hunger signals the need for nourishment, Fear prompts avoidance of danger, Desire motivates pursuit of goals.

Emotions act as internal feedback mechanisms that influence decision making. They signal to the mind and to the body if the current state is aligned or not with its goals. But they are more than simple signals—they are in fact able to change the state of the body and of the mind, initiating actions in a way that we could describe as derived by a cognitive process linked to a decision.

Conclusion

In this chapter, we explored the concept of goals and how they shape decision-making in various domains. A key insight is that goals are not static; they evolve as circumstances change, and they often conflict, requiring trade-offs and prioritization.
